Bit of a Geologist here.
Diamonds are actually very common. They (like most know) are simply made of carbon, and are only unique in the sense that their atomic structure (due to the electron valance pairing ability of carbon) quite literally makes it one of the hardest atomic structures in the universe (that we know of).
Hence, why Diamonds are listed on a 10 on the scale of Mohs Absolute Hardness. Given a exponential diagram (going from a Mohs scale of 1, Talc) to Diamonds, you will see a sharp curve from Mohs scale of 9 (Corundum: i.e. Sapphires/Rubies) to Diamonds.
Additionally, Diamonds are usually sourced from Kimberlites. They are deep mantle based material that have had diamonds/carbon on pockets that are (assuming) to form under extremely high temperatures and pressures (hence, being formed in deep mantle material) to which, under processes not currently understood, a supersonic type magma push is ejected from the deep mantle up through the surface, where it can run into much more solid material overhead, or extrudes to near surface where the materials cool. Then come along the miners millions of years later and decide to dig.
Diamonds are usually of small nature, many being microscopic, and are far better used in industrial applications, such as lasers and cutting saws.
And don't even get me started on DeBeers and their blood market (blood diamonds) and the absolute state of the cornered market and how insanely inflated it is.

Edit: Just one more thing, since I had a reply below about costs such as blades, etc.: Diamonds on a precious stone level require serious work. I diamond in it's natural element when pulled out of the earth looks much like quartz, or could be confused for a similar mineral. Also the initial size of the found mineral (diamond) deposit, or ore body/vein. A diamond has to be reviewed for any internal fractures or anomalies. As well, it has to be at least large enough that cutting the diamond down to angles will actually leave something left. Geometric/Face related concerns have to be met. Geochemistry of the diamond has to be determined for purity. A 'blue' diamond for example. Boron contamination. Now we get to actually get into cutting the diamond. And after starting with a 100g, now is left at 50g.

And I can imagine part of it is the effort involved in cutting and polishing the diamonds. But like everything else, worth is what a buyer and seller agree upon. When the seller is a cartel with the market cornered, the perceived worth is going to be skewed. To get an idea of the actual worth, you have to factor in the secondary market where the cartel is removed from the equation. And ask anybody who has tried to sell an engagement ring on the used market, prices are going to resemble more DeWalt than DeBeers.

Yes and no. If you are buying a diamond that has some form of chain of custody, history, verification of where found and who did the cutting, then that's the read deal. And you will pay real prices for that.
Synthetic diamonds are another option. That's where the brand name on cheap shades come from. Cubic Zirconia is an example, but those are cheap to make and buy. Lab/Industrial diamonds are synthetic as well, but are made with processes that made them just as hard as a natural diamond. Obviously much more expensive.

There isn't more diamonds than there are tomatoes, LITERALLY 133 million carats each year (https://www.cnbc.com/id/48782968) which is about 26600 kilograms, with a density of 3.51 g/cm³, that's 7.58 cubic meters, that is fucking rare.
